BitNet employs low-precision binary weights and quantized activations, maintaining high precision for optimizer states and gradients during training. It can converge with a large learning rate, demonstrating better training stability than FP16 Transformers. BitNet consistently outperforms both Pre-LN and BMT, showcasing the advantages of quantization-aware training approaches over post-training quantization methods.

The Era of 1.58-Bit Large Language Models

Transformer models have become the de facto standard for various natural language processing (NLP) tasks, such as machine translation, text summarization, and language modeling. However, as Transformer models become larger and more complex, they also become more computationally expensive and memory-intensive, making them challenging to deploy on resource-constrained devices. Our findings reveal that directly applying 1-bit quantization to smaller models like Llama2–7B results in suboptimal performance. Yet, after fine-tuning, the 1-bit model substantially improves, even outperforming the Quip# 2-bit model, trained on merely ~2.8K samples with a 1024 context window.

Moreover, the 2-bit models, with more specialized data, show impressive results. Notably, the Llama2–7B 2-bit model, enhanced with HQQ+, surpasses the full-precision model’s performance on Wikitext. The chat model similarly excels over its full-precision equivalent on the GSM8K dataset, given sufficient math and reasoning data.

These are our preliminary findings, and we are eager to extend our research to larger models. However, being limited by GPU resources, we invite the community to collaborate and help drive this exciting field forward.
